Are We Forcing GenAI Where ML Works Better?

Walk into any boardroom today and you’ll find two questions sitting at the head of the table. The first: “Are we using AI?”—is usually met with a confident yes. The second: “Is it actually showing up on the bottom line?”—often leads to a long, thoughtful silence.

That silence exists because we are currently living through a great corporate illusion.

Generative AI has been the star of the show for a reason. It creates a powerful, immediate effect: the feeling that every single employee has a superpower at their fingertips. Because GenAI is personal and accessible, it’s easy to assume that if everyone is “using AI” to write better emails or summarize meetings, the company’s ROI must be skyrocketing.

But here is the catch: Individual sparks of productivity do not scale into enterprise ROI without a structured process.

When AI usage stays as a series of isolated “personal endeavors,” it becomes a black box. If you don’t organize these tools into structured workflows, you hit two major walls:

  • The Measurement Gap: You can’t manage what you can’t measure. If AI usage is fragmented across hundreds of individual desks, you can’t track its impact on the business. You might see token consumption go up, but you won’t see your operational costs go down.
  • The Productivity Vacuum: The goal of AI isn’t just to “do things faster,” but to reorganize how your team spends their time. When AI decisions are unbalanced: overinvesting in GenAI can overshadow more structured, scalable ML systems that drive consistent ROI.

The pressure to use AI is real. So is the pressure to prove it works.

One of the clearest signs of the moment we are in is how aggressively some companies are starting to measure AI adoption itself.

A recent Business Insider article described how JPMorgan built internal dashboards to track engineers’ usage of tools like GitHub Copilot and Claude, scoring and categorizing usage patterns across its technology organization. Some developers reportedly felt pressure to increase usage simply to avoid being flagged as underperforming, even as the company said the data was meant to assess the effectiveness of its AI investments.

That example says a lot.

When organizations start measuring token usage, prompt activity, or AI tool adoption at that level, it can create the impression that more GenAI use automatically means more value. But usage is not ROI. And a higher volume of AI-assisted activity does not always translate into better processes, better decisions, or stronger economics.

In fact, it can do the opposite. It can push teams to force GenAI into tasks where a simpler predictive model, a narrower machine learning workflow, or even a traditional automation layer would be more reliable and more cost-effective.

That is part of what makes the current moment tricky. GenAI is often the first thing executives think of when they hear “AI,” but that does not mean it should be the first thing they deploy at scale.

Pattern Detection vs. Token Prediction

One common misconception frames GenAI as the “final evolution” of AI, the inevitable next step in a linear technological progression. In reality, these models represent completely different categories of capability. Understanding the difference requires looking at what each model is actually trying to predict.

Traditional Machine Learning (ML) detects patterns in data to predict a specific, concrete outcome. This type of AI analyzes historical data to determine what will likely happen next.

Think of an assembly line: a predictive model monitors vibration and heat data directly from sensors. It draws a direct line from past data to a concrete event (like an impending bearing failure) weeks before a human detects it. This allows for scheduled maintenance, preventing a million-dollar line stoppage through automated, mathematical foresight.

GenAI detects patterns in language to predict the next token. This model never looks at a database to find a fact; instead, it navigates a massive map of human communication to find the most “plausible” next word.

Following the assembly line example: GenAI acts as a conversational interface. A technician asks a chatbot for troubleshooting steps or a summary of repair logs. Here, the AI is not predicting the state of the machine; it is predicting the content of the answer. The model is optimized for verisimilitude (making a sentence sound plausible) rather than calculating the physical probability of failure. This creates a kind of “reliability gap” inherent to LLMs.

In simple terms, the AI might provide a perfectly coherent repair guide for a machine that hasn’t actually shown signs of failure, or even hallucinate a maintenance step that sounds logical but is physically incorrect.

Interestingly, this gap represents a design choice rather than a defect. Even OpenAI CEO Sam Altman notes that “hallucinations” are actually GenAI’s biggest strength. During a conversation with Marc Benioff, Altman pointed out:

“One of the sort of non-obvious things is that a lot of value from these systems is heavily related to the fact that they do hallucinate. If you want to look something up in a database, we already have good stuff for that. But the fact that these AI systems can come up with new ideas and be creative, that’s a lot of the power.”

For a creative team, those “creative hallucinations” act as a feature. For a CIO tasked with automating a supply chain or a risk model, that inherent variability becomes a liability. Business value depends entirely on the context. Summarizing a policy or brainstorming a campaign makes GenAI an incredible asset. Predicting a concrete business event to trigger an automated decision makes traditional ML the superior choice precisely because it is designed to be a mirror of your data, not a storyteller.

And that is, basically, why we keep saying over and over again that both types of AI are suited for different tasks. Forcing the use of one type of AI (no matter how innovative or cutting-edge it may seem) would be a waste of resources.

Traditional ML Is Your Fastest Path to ROI If…

So, now that we have drawn a clear line between the strengths of each model, we can address the bottom line. Identifying the specific scenarios where traditional ML outperforms GenAI is the only way to deliver faster, cheaper, and more reliable results.

If the goal involves hardening core processes to move the needle on ROI, traditional ML wins most of the time under these conditions:

1. The ROI drain of brute-forcing an overengineered solution

As established earlier, the fundamental difference lies in the objective: while Predictive AI focuses exclusively on finding mathematical patterns within your datasets, GenAI strives to get “creative” to construct a plausible response. At first glance, GenAI appears more attractive because third-party models offer a “plug-and-play” start. However, using a generalist tool for a specialist’s task eventually forces a cycle of overengineering. To close the “reliability gap,” teams often stack layers of complexity (fine-tuning, RAG architectures, or constant prompt iterations) trying to “train” a storyteller to act like a calculator.

Each of these layers exponentially increases project costs and compute latency, pulling the project further away from actual ROI. For companies with existing ML infrastructure, abandoning a functional predictive model to “upgrade” to GenAI rarely makes financial sense. A better approach involves adding GenAI as a layer on top of the existing process. For example, using a predictive model to identify a machine failure and GenAI to generate the specific repair manual for the technician.

The decision between the two often comes down to error tolerance and cost structures. GenAI may serve as a cheap, plug-and-play solution for low-stakes tasks like lead detection, where minor inaccuracies are acceptable and teams can easily learn to manage the output. Conversely, high-precision operations like fraud detection demand the deterministic stability of traditional ML.

While Predictive AI often requires a higher upfront CAPEX investment for data preparation, its ongoing maintenance remains stable. GenAI operates on a volatile OPEX model where costs can skyrocket unexpectedly during scaling (whether through “per-seat” licensing or massive API token consumption), turning a “simple” implementation into a long-term financial burden.

2. If you want to automate workflows, not create more review work

True enterprise value usually breaks down into two categories: Hard ROI and Soft ROI. Hard ROI is clearly measurable (direct cost savings, headcount reduction, or increased output). Soft ROI is more about “quality of life,” like better employee experience while they are doing their everyday tasks. The problem right now is that too many companies are chasing Soft ROI with GenAI while leaving the massive, process-level gains of Hard ROI on the table.

Traditional ML thrives on Hard ROI because it enables straight-through processing. The workflow is a closed loop: data comes in, a prediction is made, and a business rule triggers an action immediately. Whether it’s automatically adjusting inventory levels based on a demand forecast or flagging a fraudulent transaction in milliseconds, the system moves without needing a “hallucination check.”

GenAI, however, is significantly harder to bake into a business process. Because its output is open-ended, most organizations feel forced to keep a human in the loop to validate every response. Instead of fully automating a workflow, you’ve simply turned your employees into editors. This creates an integration wall; while an individual might feel between 10 – 15% (Bain & Company) faster “playing with the tools,” that efficiency rarely scales to the department level because the process still hinges on manual review.

If the goal is to cut process costs or increase decision speed at scale, Traditional ML gets you there faster. It operationalizes without constant supervision, whereas GenAI often replaces a “doing” task with a “checking” task, keeping your operational costs higher than they need to be.

3. If your process depends on consistent, repeatable outputs

Not every use case can tolerate variation. If you’re drafting an email or summarizing a document, small differences in output don’t matter. They can even be helpful.

But in many enterprise processes, consistency is non-negotiable. If the same input happens 10,000 times, the system is expected to behave the same way 10,000 times. That’s how fraud systems, pricing engines, risk models, and operational workflows are designed.

Traditional ML fits naturally into that requirement. Given the same input and model state, it produces the same output. That makes it easier to test, monitor, and trust in production.

GenAI behaves differently. It is a probabilistic system, meaning it generates outputs based on likelihood rather than determinism. Even when configured carefully, responses can vary depending on prompt structure, context, or internal sampling.

4. If you need your AI to become a competitive advantage

There’s a difference between using AI and building something with it.

With third-party GenAI, getting started is easy. You can adopt it through seat-based copilots or API access and start generating outputs right away.

But differentiation is where things get harder.

To make those outputs truly useful in a business context, you need to inject your own data, your own logic, your own context. That usually means building layers around the model: retrieval systems (RAG), prompt orchestration, evaluation pipelines, and continuous tuning.

And that requires highly specialized skills that are still scarce and in high demand, and hard to find without the right partner.

In other words, what starts as “easy to adopt” quickly turns into a system that needs to be engineered and maintained.

Traditional ML works differently. It is built directly on your data from the start. It learns patterns specific to your operations, your customers, your assets. That makes it inherently more tied to how your business actually works.

So instead of wrapping a generic model with context, you’re training a model on your context.

That’s a big difference.

If your goal is to build something that is hard to replicate and directly linked to your core operations, traditional ML often gets you there in a more direct and defensible way.

5. If your goal is to scale without losing control over costs

Getting started with GenAI is relatively easy. Scaling it is a different story.

There are two common paths, and both come with trade-offs.

If you scale through per-seat subscriptions, you run into an efficiency problem. Usage is never evenly distributed. Some users rely heavily on the tool and hit limits quickly, while others barely use it. That leads to wasted capacity on one side and bottlenecks on the other.

On top of that, real impact depends on adoption. That means training teams, defining use cases, and building a culture around when and how to use it. Without that, you’re paying for licenses that don’t translate into value.

And even then, GenAI doesn’t apply equally to every task. It works well as a personal assistant, but not every workflow benefits from a conversational layer.

If you scale through APIs, the challenge shifts. Costs become tied to usage. Every request consumes tokens, and as adoption grows across teams or processes, inference costs can increase quickly and unpredictably.

That makes it harder to control spending, especially in high-volume environments.

Traditional ML tends to behave differently at scale.

Once a model is trained and deployed, it can run continuously with a much lower marginal cost per prediction. There are still costs, of course (infrastructure, monitoring, retraining), but they are usually more stable and predictable over time.

More importantly, ML integrates directly into processes. It doesn’t depend on user behavior or adoption patterns. It runs as part of the system.

A developer uses Claude AI to analyze logs, debug errors, and suggest possible fixes. It helps the developer move faster, but still requires interaction, interpretation, and validation before anything goes into production.

Scaling this means more licenses or more API calls, plus training teams to use it consistently.

How this plays out with ML in a logistics process

A predictive model analyzes delivery data in real time and estimates the probability of delays across routes. When a threshold is reached, the system automatically reroutes shipments, adjusts schedules, or triggers alerts.

There’s no manual interaction required per decision. The system runs continuously as part of the operation.

In the first case, you are scaling usage.
In the second, you are scaling a process.

Conclusion

None of this makes GenAI less important. It’s incredibly useful when the task involves generating, summarizing, explaining, translating, or interacting through natural language. It also plays a key role in improving traditional ML workflows, from data preparation and documentation to code generation and interface design.

But how you scale it matters.

When you scale usage, ROI depends on how people use the tool, how consistently they adopt it, and how efficiently that usage is distributed.

When you scale a process, ROI compounds through volume, consistency, and a cost structure that becomes more efficient over time.

That’s why, in many cases, scaling the process is what ultimately drives stronger and more predictable returns.

In practice, the best architectures are not about choosing between predictive AI and GenAI. They combine both.

Predictive AI handles decision-making and automation.
GenAI supports interaction, context, and productivity.

This is not a war between “old AI” and “new AI.” The real question is simpler: what kind of problem are you solving, and what kind of output does the business actually need?

Once that becomes clear, the technology decision tends to follow.

The real risk is choosing GenAI for the wrong reasons.

Right now, there is a lot of pressure in the market. Pressure to adopt, to signal innovation, to prove that the company is not falling behind.

But when that pressure leads teams to force GenAI into every AI initiative, companies can end up spending more while getting less predictable outcomes and weaker links to measurable value.

That doesn’t mean GenAI is overhyped in itself. It means it is often overapplied.

And in that context, traditional ML deserves a more deliberate role in the conversation, especially for leaders who are being asked to deliver results in the near term.
